Neuro-Symbolic Artificial Intelligence: Integrating Large Language Models with SMT Solvers, Knowledge Graphs, and Formal Automated Theorem Provers

Abstract—Modern deep neural networks, particularly autoregressive Large Language Models (LLMs), have achieved state-of-the-art empirical performance across natural language generation, semantic translation, and broad pattern recognition. However, pure statistical connectionist architectures suffer from fundamental epistemological limitations: ungrounded factual hallucinations, an inability to guarantee mathematical soundness across multi-step deduction, brittle out-of-distribution reasoning, and a complete lack of formal explainability. Conversely, classical symbolic Artificial Intelligence (AI)—encompassing Satisfiability Modulo Theories (SMT) solvers, formal interactive theorem provers (e.g., Lean 4, Coq, Isabelle), and first-order ontological Knowledge Graphs—provides deterministic logical rigor, provable soundness, and certified safety verification, yet struggles with ambiguous perceptual inputs, continuous representations, and combinatorial state space explosion. Neuro-Symbolic AI establishes a transformative synthesis uniting statistical neural learning with rigorous symbolic reasoning. This paper presents an exhaustive, mathematically formal technical survey and empirical benchmark of neuro-symbolic systems across three mission-critical domains: automated mathematical olympiad proving, certified software verification, and high-stakes autonomous policy execution. We formalize differentiable fuzzy logic t-norm relaxations, model neural-guided proof search over formal tactic trees, and evaluate verified feedback loops using SMT counterexample-guided abstraction refinement (CEGAR). Furthermore, we construct an empirical evaluation testbed across 1,000 rigorous verification problems spanning the miniF2F formal mathematics benchmark, SMT-LIB program assertions, and complex multi-hop knowledge graphs. Our empirical findings demonstrate that neuro-symbolic integration elevates formal Lean 4 theorem proving success from 28.4% (pure LLM sampling) to 64.2% while guaranteeing 100% mathematical soundness. Concurrently, SMT-guided neural code repair eliminates 94.6% of verified runtime invariant violations. Finally, we formulate open challenges in end-to-end differentiable symbolic unification, scalable bidirectional semantic parsing, and certified neuro-symbolic alignment.
