Data-driven insights into speech impairment: an indepth survey of learning techniques, challenges, and opportunities
The emergence of data-driven computational intelligence has significantly advanced impaired speech analysis in large-scale and clinically diverse healthcare environments. However, the effective exploitation of heterogeneous, multimodal, and resource-constrained speech data remains a critical challenge for developing robust and generalizable systems. This survey presents a structured and comprehensive review of impaired speech processing, covering key tasks including detection, recognition, severity assessment, reconstruction, and assistive technologies in clinical and real-world settings. A unified taxonomy is introduced to organize the literature across classical machine learning methods, hybrid deep learning architectures, and modern representation learning paradigms. The survey further examines acoustic modeling evolution and highlights data-centric challenges such as data heterogeneity, cross-corpus variability, annotation scarcity, and the lack of standardized large-scale benchmarks, which limit reproducibility and model generalization. The survey also reviews widely used impaired speech corpora and benchmark datasets that support training, evaluation, and cross-corpus analysis of speech impairment models. In addition, the role of federated learning and distributed learning paradigms is discussed as an emerging direction for privacy-preserving and scalable clinical speech intelligence. The survey critically analyzes inconsistencies in evaluation protocols and deployment constraints in real-time healthcare environments. Finally, future research directions are outlined toward scalable and clinically deployable impaired speech systems, emphasizing multimodal learning, cross-corpus adaptation, self-supervised learning, standardized benchmarking, and data-centric AI within large-scale healthcare ecosystems.
