Failure-Aware Data Engineering: Modeling, Detecting, and Mitigating Data Failures in Large-Scale Pipelines
Modern data engineering systems face unprecedented challenges in maintaining reliability and data qualityacross large-scale pipelines that process petabytes of data daily. This technical report presents a comprehensiveanalysis of failure-aware data engineering, focusing on practical detection techniques, mitigation strategies, and architectural patterns for ensuring resilience in machine learning pipelines, ETL workflows, streaming dataarchitectures, and batch processing systems. Through systematic review of 30 highly relevant research papersand production systems, we identify three critical pillars of failure-aware data engineering: (1) proactivefailure detection using hybrid rule-based and machine learning approaches, (2) automated mitigation throughself-healing architectures and fault-tolerance patterns, and (3) platform-specific implementations acrossstreaming systems (Apache Kafka, Apache Flink) and batch processing frameworks (Apache Spark, Hadoop).Key findings reveal that reactive dataflow models, federated learning for distributed fault detection, andexactly-once semantic guarantees represent the state-of-the-art in ensuring pipeline reliability. This reportprovides rigorous theoretical foundations, experimental validation results from production deployments, and actionable recommendations for practitioners building resilient data infrastructure in cloud-nativeenvironments.
