Real-Time Detection of Malicious IP Addresses using Graph Neural Networks: A Cross-Protocol Machine Learning Approach
Modern cybersecurity faces an escalating crisis where sophisticated threat actors exploit malicious IP addresses as pivotal attack infrastructure, with traditional reactive detection methods failing to identify threats until significant damage occurs. Current approaches suffer from protocol isolation, limited contextual understanding, and inherent time delays that enable successful cyberattacks. This paper presents a revolutionary multi-dimensional cybersecurity framework that integrates Graph Neural Networks (GNNs) with cross-protocol behavioral analysis to model complex relationships between network entities. Our approach combines semi-supervised graph-based learning with real-time feature extraction across HTTP, DNS, SMTP, and network flow protocols, enabling high-accuracy detection with minimal labeled data requirements. Experimental evaluation demonstrates unprecedented 98.2% detection accuracy with 96.8% F1-score while maintaining sub-$\mathbf{5 0 m s}$ response latency at $\mathbf{5 0, 0 0 0}$ assessments per second. Most significantly, we achieve proactive threat detection capability, identifying malicious IPs an average of 18.7 hours before conventional blocklist appearance. This early warning capability transforms cyber defense from reactive to anticipatory, providing critical response time for implementing protective measures and representing a paradigm shift toward intelligent, anticipatory cybersecurity.
