Redefining Crash Prediction with Interpretable Machine Intelligence
Models for predicting crashes in financial markets have historically used correlational methods which lack explainability and overlook the fundamental economic anomalies. This gap is addressed in this study by forecasting economic contractions-and subsequently explaining their real-time causal drivers-with a causality-based predictive pipeline. The synthesis of a complex macroeconomic dataset is achieved through domain-informed Gaussian and skewed Bernoulli distributions which in turn facilitates more accurate simulations of financial behaviors. This novel contribution drives the proposed methodology which adopts an artificial neural network (ANN) architecture incorporating Gradient Boosting simulation to deliver probabilistic crash forecasts. The architecture utilizes ReLU-activated hidden layers, dropout regularization, and sigmoid binary classification to probabilistic outputs, with ensemble predictions layered against exponential decay weights to mitigate overconfidence. The explainable AI features providing ensemble-level classification diagnostics capture model confidence beyond blurs and feature importance visualizations step away from conventional opaque architectures. The evaluation metrics included F1 Score, RMSE, $\mathbf{R}^{\mathbf{2}}$, and log loss with the model demonstrating sharp recall and precision limitations tempered by insight into key economic indicators determining market crash thresholds. Even with a modest predictive performance with F1 Score of 0.0526 and Accuracy of $\mathbf{8 2 \%}$, the research lays undisputed claim to establishing the groundwork for reasoning-based, traceable financial risk prediction which strive for proactive economic decision-making in uncertainty.
