Manifold Learning for Indoor CSI Localization: Boosted Isomap & SVM
This paper addresses the critical challenge of accurate indoor localization in complex signal environments through a novel integration of manifold learning and machine learning techniques. We propose a real-time system leveraging Wi-Fi Channel State Information (CSI) that combines optimized Isomap dimensionality reduction with Support Vector Machine (SVM) classification. The methodology features three key innovations: a parallelized Isomap implementation achieving 6.9× acceleration through block-wise Floyd-Warshall optimization, hybrid SVM with Bayesian-optimized hyperparameters, and cascaded Hampel-wavelet denoising enhancing SNR by 8.7dB. Extensive experiments in dynamic office environments demonstrate 1.26m median accuracy (95th percentile ≤1.29m), outperforming PCA/SVD baselines by 34% (p<0.001) while maintaining 25Hz update rates. The system's computational efficiency (38ms latency, 145MB memory) and cost-effectiveness (30× cheaper than UWB solutions) are validated through rigorous benchmarking. Our analysis reveals Isomap's superior neighborhood preservation (Davies-Bouldin index 0.82 vs 1.14 for PCA) as the key enabler for SVM margin optimization. This work establishes a practical framework for high-precision indoor positioning using existing Wi-Fi infrastructure, with significant implications for accurate indoor positioning without specialized hardware.
