Automated Meta-Learning Frameworks for Dynamic Neural Architecture
Optimal design of neural network architecture is one of the critical tasks in deep learning and usually requires lots of time. Traditional methods tune this in a manual way or by an exhaustive search over the architecture space, which has been computationally expensive and inflexible against changes in patterns in data. We propose an automated meta-learning framework that allows neural architecture adaptation in a dynamic way during training. Our framework leverages meta-learning methods that will enable neural networks to learn both their parameters and architectures using data-driven approaches. We introduce a novel algorithm that integrates architecture optimization with the learning process by considering architectural decisions as meta-parameters. By its dynamic adjustment, the network self-organizes a suitable architecture based on its progress in learning and data characteristics, hence improving performance and generalization capability. The framework automates the choice of layers, nodes, and their connections, hence reducing the need for manual intervention and hyperparameter tuning to a great extent.Extensive experiments on benchmark datasets demonstrate the effectiveness of our method for both image classification and natural language processing tasks. Such a dynamically adapted architecture, compared to their static counterparts and other neural architecture search methods, shows an ever-improving result in accuracy and computational efficiency. Moreover, our framework exhibits superior adaptability to a variety of tasks and data distributions without significantly increasing training time. Our results point to the potential of automatic meta-learning frameworks in developing more efficient and adaptable deep learning models. Automating architectural design will indeed enable the development of neural networks that better adapt to varied requirements, a key ingredient in accelerating AI solution development and deployment in real-world applications.
